An intelligent web application that predicts Remaining Useful Life (RUL) of industrial machinery using multi-sensor data analysis. Built with a hybrid CNN-LSTM architecture, this system analyzes vibration, temperature, and current sensor readings to forecast equipment failures before they occur, enabling proactive maintenance and reducing costly downtime.

Imagine knowing exactly when your industrial machinery will fail - before it happens. This system analyzes sensor data from equipment (vibration, temperature, current) and predicts:

Installation

Step 1: Prepare Your Data

You need two CSV files:

  • Temperature/Current file: Motor temperature + 3-phase current readings
  • Vibration file: X/Y vibration from equipment housings

Step 2: Upload & Predict

  1. Navigate to the "Try Model" page
  2. Select your model type (Misalignment or BPFI)
  3. Upload both CSV files
  4. Click "Predict RUL"

Step 3: Interpret Results

The dashboard shows:

Deep Dive: The Prediction Process

1️⃣ Data Preprocessing (/predict endpoint)

# Original high-frequency data (25,600 Hz)

# Why resample?
- Reduces data by 25.6× (faster processing)
- Retains critical frequencies (< 500 Hz)
- Machine faults typically occur below 500 Hz

2️⃣ Feature Engineering

Windowing Strategy:

  • Window size: 2,000 samples (2 seconds at 1 kHz)
  • Overlap: 50% (to catch transitional patterns)
  • Result: ~100-120 windows per minute of data

For each window, we extract 103 features:

Time-Domain (80 features):

For each of 10 sensors:
  - Mean, Std Dev, RMS
  - Peak, Peak-to-Peak
  - Crest Factor, Kurtosis, Skewness

Frequency-Domain (12 features):

For vibration sensors (FFT analysis):
  - Spectral Centroid (center frequency)
  - Spectral Variance (frequency spread)
  - Misalignment Energy (100-200 Hz band)

Engineered Features (11 features):

- Cross-channel correlations
- Harmonic ratios (1x, 2x, 3x rotation)
- Energy band distributions

Why These Specific Conditions?

Shaft Misalignment Progression:

0.0mm → Perfect alignment (Optimal operation)
0.1mm → Acceptable in most machinery (Early warning)
0.3mm → Causes accelerated wear (Maintenance needed)
0.5mm → Critical - imminent failure (Emergency intervention)

Real-world machinery degrades gradually from 0.0mm to 0.5mm+ over weeks/months. Our model learns this progression pattern.

Key Insight: Vibration features (especially X-direction at Housing A) contribute 70% of prediction power. This validates domain knowledge that vibration is the primary indicator of mechanical faults.

🔬 Model Training Details

Synthetic Data Generation

Challenge: Real-world equipment rarely fails in controlled conditions. We only had 4 discrete fault states (0.0, 0.1, 0.3, 0.5mm).

Solution: Generated 24,000 synthetic degradation trajectories

Data Augmentation (4× multiplier)

  1. Jittering: Add Gaussian noise (σ = 0.01)

  3. Magnitude Warping: Multiplicative noise
  4. Time Shifting: RUL adjustments (±0.5 min)

Training Configuration

Optimizer: Adam (lr=0.001)
Loss: Mean Squared Error (MSE)
Batch Size: 32
Epochs: 100 (with early stopping)
Validation Split: 15%
Callbacks:
  - EarlyStopping (patience=15)
